Understanding Spiking Neural Networks: Bridging the Gap Between Biological and Artificial Intelligence

In contrast, biological systems exhibit remarkable intelligence with minimal energy consumption, showcasing creativity, problem-solving abilities, and multitasking skills. This disparity has led to the exploration of Spiking Neural Networks (SNNs), which aim to mimic the efficiency and functionality of biological neural systems.

The Need for Spiking Neural Networks

Biological neurons operate fundamentally differently from the artificial neurons used in traditional ANNs. While ANNs process information as continuous values, biological neurons communicate through discrete spikes—rapid changes in electrical potential. This spike-based communication allows biological systems to efficiently process information and respond to stimuli in real-time. Understanding the mechanisms behind this natural intelligence has inspired the development of SNNs, which leverage the temporal dynamics of spikes to enhance learning and processing capabilities.

In this article, we will delve into the theoretical foundations of SNNs, explore their advantages over traditional ANNs, and provide a simplistic implementation of SNNs using PyTorch.

Information Representation: The Spike

The primary distinction between biological neurons and artificial neurons lies in how they represent and transmit information. Biological neurons generate spikes—brief bursts of electrical activity—rather than continuous values. When the membrane potential of a neuron surpasses a certain threshold, it emits a spike, which propagates to connected neurons through synapses. This process allows for asynchronous communication, enabling neurons to transmit information independently of one another.

The Leaky Integrate-and-Fire Model

To model the behavior of biological neurons, we can use the Leaky Integrate-and-Fire (LIF) model, which simulates the dynamics of a neuron as an electrical circuit. In this model, the neuron’s membrane potential increases when it receives input spikes and decays over time if no new spikes arrive. When the membrane potential exceeds a predefined threshold, the neuron emits a spike and resets its potential.

Rank Order Coding

Rank Order Coding encodes information based on the timing of spikes. In this method, the first spike represents the highest value of the signal, while subsequent spikes represent lower values. This approach preserves the temporal information of the input, allowing for more nuanced processing.

Dynamic Vision Sensors (DVS)

Dynamic Vision Sensors (DVS) represent a significant advancement in capturing spatiotemporal data. Unlike traditional cameras that capture frames at fixed intervals, DVS detect changes in brightness and generate spikes only when significant changes occur. This event-driven approach allows DVS to operate at high frequencies (up to 1 MHz) while consuming significantly less energy than conventional cameras. The output from a DVS includes information about the occurrence of spikes, their spatial coordinates, timestamps, and polarity, making them ideal for applications in robotics and AI.

Training Spiking Neural Networks

Training SNNs involves adjusting the synaptic weights that connect neurons, similar to the learning process in biological systems. One prominent learning rule used in SNNs is Spike-Timing-Dependent Plasticity (STDP), which is based on the principle that "neurons that fire together, wire together." STDP modifies synaptic weights based on the timing of pre-synaptic and post-synaptic spikes, reinforcing connections that contribute to successful firing patterns.

Implementation of SNNs in Python
